I wasn’t going to write another article about artificial intelligence adoption. The topic felt overdone, and I’d seen too many breathless takes about “overhaul” that ignored what actually happens when companies try to deploy this stuff.

But then I spent the last seven months interviewing teams at 14 organizations – from a Midwest insurance company to a Silicon Valley startup – about their AI projects.

Now, I know what you’re thinking — “another article about Artificial Intelligence, great.” Fair enough. But here’s why this one’s different: I’m not going to pretend I have all the answers. Nobody does, not really. What I can do is walk you through what we actually know, what’s still fuzzy, and what everybody keeps getting wrong.

And the pattern that emerged wasn’t what I expected. Here’s what I found:

I went in looking for technical debt or messy data pipelines. What I found was something harder to categorize.

Now for the part that people always seem to skip over. I get it — this isn’t the flashy stuff.

But if you actually care about getting Artificial Intelligence right, this matters more than everything else combined.

What Everyone Gets Wrong About AI Readiness

The Infrastructure Myth

Most executives I talked to believed they needed better infrastructure before deploying AI, cloud migration, data lakes, the works. The data shows otherwise.

According to a McKinsey analysis published in October 2024, infrastructure gaps account for only a notable share of AI project failures. The bigger problem? Companies can’t agree on what success looks like.

There’s this stubborn idea that real AI requires a roster of PhD data scientists. So companies burn six months recruiting for roles they haven’t actually defined yet.

But here’s the thing: IBM’s Institute for Business Value found that more than half of successful AI implementations started with existing staff who learned as they went. Not glamorous. But totally functional.

Because most people miss this.

The “Change” Delusion

Here’s the thing – organizations keep framing AI as a change initiative when it should be treated like process improvement with better math. That framing alone kills projects.

That figure gets repeated everywhere. What rarely gets airtime is how much of that spending delivers actual value.

Think about it — does that really add up?

IDC’s research team tracked 847 AI projects across Fortune 500 companies from January 2022 through March 2024. They found that $billions of was spent on initiatives that were eventually shelved, restructured, or quietly abandoned. That’s not a rounding error. That’s roughly the GDP of Luxembourg.

The breakdown is kind of grim. Of that $billions of, roughly $billions of went to proof-of-concept work that never scaled. Another $billions of got burned on data preparation for models that were never trained, the remaining $billions of? Integration costs for systems that couldn’t talk to each other.

And that matters.

I reviewed budget documents from three different companies (they requested anonymity, which makes sense). All three had allocated between $millions of and $millions of for what they called “AI change” in 2023.

None could explain what they’d actually shipped. One CTO admitted they’d basically rented some GPUs and hired consultants to write PowerPoint decks (stay with me here).

What I’m about to say might rub some people the wrong way. That’s fine, it’s not my job to be popular.

When it comes to Artificial Intelligence, there’s a lot of conventional wisdom floating around that just… doesn’t hold up under scrutiny. Not all of it — but enough to matter.

Where Small Teams Are Beating Enterprise Giants

Frankly, this is where it gets interesting. Or companies under 500 employees are deploying AI at roughly the same success rate as organizations with 50,000+ staff, according to research from MIT Sloan Management Review.

But they’re doing it for 1/40th the cost (I know, I know).

Why the difference? Smaller teams cannot afford to experiment with $millions of budgets. They use off-the-shelf APIs, pre-trained models, and actually talk to the people who’ll utilize the tool they’re building — groundbreaking stuff.

The Data Preparation Time Sink

When I first tried building an AI model for customer segmentation back in early 2023, I made the classic mistake of assuming our data was “good enough.” It took me three months before I realized we were training on garbage. The model worked beautifully. It just classified customers based on patterns that didn’t actually exist in reality.

Turns out this pattern repeats itself. And anaconda’s 2024 State of Data Science survey found that data scientists spend a considerable portion of their time on data cleaning and preparation. Not model building. But not tuning. Cleaning. And most organizations have no idea this is happening because the work is invisible until something breaks.

Why Integration Kills More Projects Than Technology

The conversation in the AI community right now is whether you should build custom models or use foundation models with fine-tuning. The data suggests this is the wrong debate.

According to Deloitte’s 2024 State of AI report, more than half of failed projects had perfectly functional models. They just couldn’t get them into production systems.

Actually, let me walk that back a bit – it’s not that they couldn’t. It’s that the effort required was so much higher than anyone estimated that the project got deprioritized. Then canceled. Then quietly forgotten.

The results are pretty solid. They reduced out-of-stock incidents by a serious portion and cut excess inventory carrying costs by $billions of annually. So those numbers come from Walmart’s Q3 2024 earnings call, where CFO John David Rainey specifically attributed the savings to their AI inventory system.

But here’s what they do not advertise: it took five years and roughly $millions of to secure there, the first two years were just data infrastructure – standardizing how stores reported inventory, fixing SKU databases, building the pipeline. The actual AI model? That was the easy part (bear with me).

Actually, let me back up. nobody talks about this.

What caught my attention is that Walmart didn’t frame this as an “AI initiative.” They called it “inventory optimization”. And happened to employ machine learning.

That framing shift probably saved the project when it hit roadblocks.

What Gary Marcus Gets Right (And Wrong)

Gary Marcus, the NYU professor. And AI researcher, has been arguing for years that we’re over-indexing on deep learning and ignoring core limitations.

In a December 2023 interview with VentureBeat, he said: “Most commercial AI applications are solving the wrong problems with the wrong tools. The tools are trendy.”

He’s sort of right? The data backs up the first part.

MIT Technology Review analyzed 3,400 AI deployments. And found that a big portion could have been solved with basic statistical methods or rule-based systems.

Companies were using neural networks because they could, not because they should. But Marcus overlooks the institutional dynamics. Sometimes you need the “trendy” tool to get budget approval.

A regression analysis doesn’t unlock a $millions of investment. An AI initiative does. Is that cynical? Absolutely. Is it how organizations actually work? Also yes.

The Adoption Gap Is Widening, Not Closing

There’s been a lot of back-and-forth in the AI community about whether adoption is accelerating or plateauing. The data suggests something weirder: it’s bifurcating. Or according to the Boston Consulting Group’s December 2024 survey of 1,500 companies:

  • Companies with 1+ successful AI deployment increased AI spending by 47% year-over-year
  • Companies with 0 successful deployments decreased AI spending by a notable share
  • The middle ground – companies actively experimenting – shrunk from 38% to 19% of respondents

Organizations are either going all-in or checking out entirely. And the experimentation phase is ending. You’re either building institutional capability or you’ve decided this isn’t for you. At least not yet.

PwC’s AI predictions for 2025 estimate that by the end of next year, more than half of large enterprises will have at least one production AI system. But the same report notes that a major majority of those systems will be serving fewer than 1,000 internal users. So yes, adoption. But not exactly at scale.


Where This Leaves Us

Quick clarification: So what’s coming next? My read is that we’re about to see a wave of consolidation — not in vendors, but in use cases. The “AI can do anything” narrative is dying. It’ll acquire replaced by “AI is really good at these seven specific things.”

Organizations that succeed will be the ones that stop treating AI as a technology initiative. And start treating it as a capability that exists within normal business processes. Unsexy. Boring. Effective.

Let me be real with you — I don’t have this all figured out. Nobody does, whatever they might tell you on social media.

But I think we’ve covered enough ground here that you can start making more informed decisions about Artificial Intelligence. That was always the goal.

The $billions of in failed spending isn’t going to disappear. But it might start producing actual returns if companies can resist the urge to transform.

And just focus on improving one process at a time.

Will every company need AI? Probably not. Will most companies waste money figuring that out? The data suggests yes.
