I wasn’t going to write another article about artificial intelligence. The topic’s been beaten to death.
Okay, slight detour here. i’m tired of reading the same breathless predictions about how AI will either save or destroy us all. But then I saw the latest numbers from McKinsey’s 2025 AI adoption report.
Something genuinely surprised me: only a notable share of organizations have embedded AI into more than one business function.
Hold on — Now, I know what you’re thinking — “another article about Artificial Intelligence, great.” Fair enough. But here’s why this one’s different: I’m not going to pretend I have all the answers. Nobody does, not really.
What I can do is walk you through what we actually know, what’s still fuzzy, and what everybody keeps getting wrong. Not more than half.
Not a big portion. Twenty-three percent.
Because that changes everything.
But then I saw the latest numbers from McKinsey’s 2025 AI adoption report.
But does it actually work that way?
After five years of nonstop AI hype, we’re still experimenting. That’s what made me sit down and write this.
Which is wild.
The Adoption Gap Nobody Wants to Talk About
Here’s what most coverage gets wrong: we treat AI adoption like it’s a done deal. But the conventional wisdom goes something like this – every company is using AI, the race is over. But if you’re not on board, you’re already obsolete.
The data tells a different story.
Actually, let me back up. according to Stanford’s 2024 AI Index Report. So while more than half of enterprises have piloted at least one AI project, the vast majority never make it past proof-of-concept, the gap between experimentation and production deployment is massive.
And it’s not because companies don’t want to employ AI – it’s because most AI projects fail before they deliver measurable ROI.
Because the alternative is worse.
The misconceptions break down like this: Misconception 1 — AI adoption is primarily a technology problem (it’s an organizational change problem)
Misconception 2 — Bigger budgets mean better results (IBM’s research shows the opposite – smaller, focused initiatives outperform sprawling programs) Misconception 3 — AI is replacing workers en masse (MIT’s research shows it’s mostly augmenting existing roles, not eliminating them)
So where does that leave us?
Misconception 4 — You need massive datasets to start (you don’t – transfer learning changed this completely)
Organizations are stuck in what Gartner calls the “AI pilot purgatory” – endless testing with no clear path to production. I didn’t expect this to still be the dominant pattern in 2025.
Nobody talks about this.
What the Production Data Actually Shows
Let’s look at what separates the companies that actually ship AI products from the ones that don’t. Deloitte’s 2024 State of AI report tracked 2,620 organizations across 13 countries — which, honestly, surprised everyone — and the patterns are pretty clear.
The organizations that successfully deployed AI into production shared three characteristics: they started with narrow use cases (not company-wide transformation), they allocated 20-a considerable portion of their AI budget specifically to data infrastructure (not model development). And they measured success in weeks, not quarters.
Or the companies still stuck in pilot mode did the opposite – they tackled big transformational projects, spent most of their budget on flashy models. Set 12-month success timelines.
Here’s the part that surprised me: PwC’s Global AI Study found that more than half of executives cite “lack of trust in AI outputs” as the primary barrier to deployment. And not cost. Not talent (and yes, I checked).
Trust. Because here’s the thing – you can build a model that’s a major majority accurate. Because if your business stakeholders don’t trust that remaining a notable share, it never goes live.
The obvious follow-up: what do you do about it?
The trust problem shows up in the numbers. According to a 2024 survey by Boston Consulting Group, more than half of AI projects that reached production were rolled back or scaled down within 18 months. That’s not a pilot problem. That’s a “we shipped something people won’t work with” problem.
And the financial impact is real. Gartner estimates that through 2025, organizations will waste roughly $trillions of on AI initiatives that never deliver measurable business value.
Where AI Is Actually Working Right Now
But let’s not pretend it’s all failure. There are specific domains where AI has moved from experiment to standard practice. The patterns are pretty consistent across industries.
Quick clarification: But here we are.
Customer service automation is probably the most mature use case. Zendesk’s 2024 benchmark data shows that more than half of customer service organizations now employ AI for first-line ticket triage. And it’s actually working – resolution times dropped by an average of a substantial portion for companies that deployed it properly. The key word there’s “properly.” Most implementations fail because they try to automate too much too fast.
Fraud detection in financial services is another area where the ROI is undeniable. FICO reported that their AI-powered fraud detection systems now catch a significant majority of fraudulent transactions. While reducing false positives by more than half compared to rule-based systems. That’s a pretty clear win. But here’s the catch – it took most banks 2-3 years to get there, not 6 months.
Predictive maintenance in manufacturing has crossed over from pilot to production at scale. According to Deloitte’s manufacturing survey, a serious portion of manufacturers now use AI-powered predictive maintenance systems.
They’re reporting 25-a considerable portion reductions in unplanned downtime. The secret? They didn’t try to predict everything at once, they started with one vital piece of equipment and expanded from there.
Key success factors across these work with cases:
- Narrow scope with clear success metrics (not “transform the business”)
- Human-in-the-loop design from day one (AI suggests, humans decide)
- Iterative deployment over 12-18 months (not big-bang launches)
- Investment in data quality before model complexity
This is where things get interesting. Not “interesting” in the polite, boring way — actually interesting. The kind of interesting where you start pulling one thread and suddenly half of what you thought you knew doesn’t hold up anymore. At least that’s what happened to me.
How Shopify Actually Did This
Let me give you a concrete example that shows what successful AI deployment looks like in practice. Shopify’s implementation of AI-powered product recommendations is one of the few cases where a company went from pilot to full production. And actually published their results.
In mid-2023, Shopify started testing AI-driven product recommendations for their 2+ million merchants. But instead of building one massive recommendation system, they broke it into three distinct models:
- A model for merchants with less than 1,000 monthly visitors (optimized for cold-start scenarios)
- A model for mid-size merchants (optimized for seasonal patterns)
- A model for high-traffic stores (optimized for real-time personalization)
The results? According to their engineering blog, merchants who adopted the AI recommendations saw an a notable share average increase in conversion rates. But here’s what most coverage missed – it took them 14 months to get there, they ran 37 separate A/B tests before they found the right balance between automation and merchant control.
Seriously (which honestly surprised me).
The most interesting finding: merchants who could easily override the AI recommendations were 3x more likely to keep using the system long-term. Trust was not built through accuracy alone, it was built through control.
What Andrew Ng Gets Right (And Wrong) About This
Andrew Ng, founder of DeepLearning.AI, has been saying for years that “AI transformation is less about technology.
And more about systematic change management.” I think he’s mostly right, but there’s a nuance here that matters. In a 2024 interview with MIT Technology Review, Ng argued that the biggest barrier to AI adoption isn’t technical capability – it’s organizational readiness. Companies fail, he says, because they treat AI like a software purchase instead of a capability they need to build internally — and the data backs this up. So organizations that created dedicated AI teams with business unit representation were 4.2x more likely to successfully deploy AI projects, according to Deloitte.
But here’s where I’d push back: Ng’s focus on organizational readiness can make it sound like the technical challenges are solved. They’re not. The challenges are not in building models anymore. They’re in model monitoring, drift detection, and keeping systems reliable in production, or deeply technical problems. Organizational change management won’t fix them.
The Real Cost Structure of Production AI
Let’s talk about money. The cost structure of AI in production is wildly different from what most budget forecasts assume (more on that in a second).
Google Cloud published a breakdown in their 2024 State of Cloud AI report that shows where production AI costs actually land:
“For every dollar spent on initial model development, organizations spend an additional $3-5 on data infrastructure, model monitoring. Ongoing retraining. The compute cost of serving a model in production typically exceeds the cost of training it within 6-8 months.”
Not great.
That ratio surprised a lot of people. Most organizations budget for training costs and treat serving costs as an afterthought — big mistake.
Here’s a more specific breakdown from Andreessen Horowitz’s analysis of AI company margins: the average AI-native company spends a substantial portion of revenue on cloud compute (compared to 10-a notable share for traditional SaaS companies). Gross margins are typically 50-more than half (compared to 70-a big majority for SaaS).
Those economics matter when you’re building a sustainable AI business.
The kicker? OpenAI’s Sam Altman mentioned in a February 2024 interview that training costs are dropping roughly a substantial portion year-over-year. But serving costs are only dropping about a notable share annually. The gap is widening. And which means the longer your AI runs in production, the more the cost equation shifts toward inference.
Where This Is All Heading
So what do I think happens next? Based on the data patterns, we’re heading toward a pretty clear bifurcation in the AI market.
On one side, you’ll have a small number of companies (maybe 15-a notable share of current AI adopters) that successfully embed AI into core business processes. These are the organizations that figured out the organizational change piece, invested in data infrastructure, and built internal AI capabilities. They’ll see legitimate competitive advantages – not revolutionary transformation, but meaningful 10-a substantial portion improvements in key metrics.
On the other side, you’ll have the majority of organizations that end up using AI mainly through third-party software. Embedded in their CRM, their analytics tools, their customer service platforms.
They will not build AI; they’ll buy products that happen to use AI under the hood. And that’s fine. For most companies, that’s probably the right call.
I’ve thrown a lot at you in this article, and if your head is spinning a little, that’s perfectly normal. Artificial Intelligence isn’t something you master by reading one article — not this one, not anyone’s. But if you walked away with even one or two things that shifted how you think about it? That’s a win.

Fair enough (stay with me here).
I think she’s right. The next phase isn’t about who can build the most sophisticated AI – it’s about who can build the most effective human-AI workflows. Because the technology is commoditizing faster than most people realize, but the organizational capability to employ it well is still rare.
If you’re evaluating AI investments right now, my advice is simple: start small, measure obsessively, and don’t believe your own hype. The organizations that succeed with AI are the ones that treat it like any other business capability – something you build incrementally, test ruthlessly. And deploy only when it clearly beats the alternative.
